Image caption is working fine, but when I check the source code of the page, image caption is not there. Image caption is being rendered through javascript. So, is there a way image caption can be shown in the source code also?

Yes, you can use the included "image caption filter" module to generate the captions with HTML.

I have indeed used the "image caption filter" and set it enabled in Filtered HTML and Full HTML. But, the filter is not working as it is not adding image caption to the source code.
